Have to say your experience is absolutely typical of my own when it comes to Mount Fuji. The reality is that I’ve mostly seen Fuji San whilst travelling to places with notable vantage points and not so much at the vantage point itself.
I received a reminder of this recently. On the 31st October I arrived in Japan amidst torrential rain and left on a morning of the 1st November with beautifully clear air.
Having been treated to panoramic views of the Tokyo skyline throughout the morning, Fuji San also decided to peep in on us at Haneda Airport:
On take off I was then presented with a marvellous spectacle;

Fuji San in the ukiyo-e style. This was one of those instances where the photograph only captures a smudged sense of the splendour.
And this is where one might think that the view will only get better with further proximity to Fuji San. I will let the next few photos communicate the reality:
